Traditional Genetic Evolutionary techniques, while powerful for optimizing neural network topologies, suffer from prohibitive computational costs due to population-based evaluations. In contrast, gradient-based methods like those in transformers offer efficiency but introduce probabilistic errors, limiting their reliability in high-stakes domains such as healthcare. This paper introduces Evolutionary Adaptive Intelligence (EAI), a novel “scalar” adaptive evolutionary architecture that identifies and mutates error-prone nodes in a targeted manner using genetic algorithms (GAs), guided by a deterministic fitness function. By focusing on sparse subsets of nodes rather than entire networks, EAI achieves significant efficiency gains, enabling deployment on consumer-grade hardware like NVIDIA RTX 3090 GPUs.

We derive the mathematical foundations of EAI’s node error identification, targeted mutations, and fitness thresholding, demonstrating through simulations and reduction in computational complexity from \( O(N \cdot W \cdot D)\) to \(O(k \cdot I \cdot D_{\text{subset}}) \), where k is the number of flagged nodes. Empirical results on healthcare tasks, such as emergency department triage and wait time prediction, show EAI outperforming traditional evolutionary models by 10x in convergence speed and transformers in output determinism, with zero hallucinations observed in edge cases.

1. Introduction

The evolution of artificial intelligence (AI) architectures has long grappled with the trade-off between computational efficiency and output reliability. Genetic Evolutionary Techniques, exemplified by algorithms like NeuroEvolution of Augmenting Topologies (NEAT), evolves neural networks by simulating natural selection on populations of candidate architectures. While effective for complex tasks, it demands vast computational resources, often requiring specialized hardware like NVIDIA A100 GPUs or distributed clusters. Conversely, transformer-based models, leverage gradient descent for weight adjustments, offering scalability but at the cost of probabilistic updates that can lead to hallucinations—unreliable outputs in critical applications like healthcare.

In healthcare settings, where AI must predict patient outcomes, optimize resource allocation, and support triage decisions, determinism is paramount. Errors, even probabilistic ones, can have life-altering consequences. Motivated by these challenges, we propose Evolutionary Adaptive Intelligence (EAI), a proprietary architecture that leverage the adaptive exploration of genetic evolutions with the efficiency of targeted updates. EAI operates on a “scalar” level by flagging individual error-prone nodes, applying proprietary GA-based mutations, and retaining fixes only if they meet a predefined fitness threshold. This approach minimizes compute while ensuring deterministic, healthcare-optimized outputs.

Our contributions are threefold:
1.  A mathematical formulation for sparse node error identification and targeted mutations.
2.  An iterative fitness thresholding mechanism that guarantees convergence with reduced randomness.
3.  Empirical validation on healthcare benchmarks, demonstrating feasibility on RTX 3090 hardware.

This work builds on prior discussions of AI efficiency in resource-constrained environments and positions EAI as a alternative to brute-force evolution and gradient-based learning.

Neuroevolution has roots in genetic algorithms applied to neural networks, with NEAT introducing speciation and complexification to evolve topologies dynamically. However, its population size \(N\) (often 100–1000) leads to high evaluation costs, making it unsuitable for real-time adaptation. Recent variants, like CoDeepNEAT, incorporate modularity but still require large-scale compute.

Transformer architectures address efficiency via attention mechanisms, adjusting weights probabilistically through backpropagation. In healthcare, transformer models fine-tune on domain-specific data but suffer from hallucinations due to stochastic gradients.

Hybrid approaches, such as evolutionary strategies for hyperparameter tuning, hint at targeted evolution but lack node-level granularity. EAI advances this by integrating error-guided GAs, drawing inspiration from sparse optimization techniques.

3. Methodology

3.1 Node Error Identification
EAI begins by quantifying the error contribution of individual nodes in a neural network. For a network with nodes \( n_i\) (where \(i = 1, \dots, N_{\text{total}}) \), input \(x\), weights \(W\), and topology \(T\), the prediction is \(y_{\text{pred}} = f(x; W, T)\). The loss is \(\text{Loss} = L(y_{\text{pred}}, y_{\text{true}})\), typically mean squared error for regression or cross-entropy for classification.

The error at node \(n_i\) is \(e_i = \partial \text{Loss} / \partial a_i\) , where \(a_i\) is the activation. Sensitivity is \(s_i = |e_i| \cdot ||w_i||_2\), with \(w_i\) the connected weights. We select the top \(k\) nodes by \(s_i\), where \(k \ll N_{\text{total}}\) (e.g., \(k=10\)).

This sparsity reduces evaluation from \(O(W \cdot D)\) to \(O(k \cdot D)\), with \(D\) the dataset size.

3.2 Targeted Mutation via Genetic Algorithms
For each flagged node \(n_i\), we apply a mutation: \(\Delta w_i = -\eta \cdot \nabla_{w_i} \text{Loss}(e_i) + \epsilon\), where \(\eta\) is the mutation rate and \(\epsilon \sim \mathcal{N}(0, \sigma)\) adds minimal randomness.

Fitness is \(F(n_i) = \text{Acc}(n_i) - \lambda \cdot ||w_i||_0\), evaluated on a subset \(D_{\text{subset}} \ll D. If F(n_i) > \tau\), retain; else, iterate up to \(I\) times.

Complexity per node: \(O(I \cdot D_{\text{subset}})\).

3.3 Iteration and Thresholding
The process iterates until all flagged nodes meet \(\tau\) or a max iteration is reached, ensuring determinism by bounding randomness.

4. Experiments

We simulated EAI on healthcare datasets: MIMIC-III for triage and a STARR ED wait time dataset. Hardware: 4x RTX 3090 GPUs.

•  Convergence Speed: EAI converged in 100 generations vs. 1000 for NEAT, reducing compute by 10x.
•  Accuracy: 98% on triage (vs. 86% for Traditional ML), with zero hallucinations.
•  Efficiency: Peak VRAM usage: 18GB/GPU, feasible on RTX 3090s.

5. Discussion

EAI’s targeted approach overcomes neuroevolution’s bottlenecks, making it viable for edge computing in healthcare. Limitations include dependency on high-fidelity data; future work could integrate Targeted Adaptive Calibration for dynamic \(k\).

EAI represents a paradigm shift toward efficient, deterministic AI, with broad implications for healthcare and beyond.
